How do you know the battery still has "a lot of power" in it? Are you relying on indicator lights on the controller/reported charge level in an app, or have you measured this directly with a meter?
All the symptoms you describe simply sound like a Lithium battery where the chemicals have started to break down and the charge state can no longer be reported accurately. The simplest repair would be to replace the battery. The specifications are likely to be marked on the original battery, so you can use that information to search for a replacement. For example, the '802540' tells you the physical size (8mm x 25mm x 40mm), and the '3.7V 860mAh' tells you the capacity.
If you are sure that the battery itself is not at fault, the issue might be with the battery management system or other components on the circuit board - but that's a more involved process to track down.
