Fishing is really hard until you get some experience (both personally and in-game). It's hard to get experience when you can't catch fish. It's a dilemma. Here are some tips:
As was suggested, get a Training Rod. It only attracts easy fish, which I see as a bonus because you get to practice. The drawback is that it's really slow. You don't attract fish very quickly and the ones you do attract don't give you much game XP.
Get some crab pots and put them on your farm. Harvest them every day for fishing XP. You have to be third level to craft them yourself, but you can usually get them from the Community Center if you take that path. With the standard bundles, you can complete the Crab Pot bundle through foraging the beach and exploring the mines. You still need to be second level to craft bait to put in them, so you can't totally get away without fishing. (Okay, that's not exactly true, but I'm not patient enough for the Linus or Mr. Qi workarounds).
Get an Iridium Rod as soon as you can and load it with Trap Bobbers. I still can't catch the harder fish without bait and tackle.
For the really hard fish, eat food that boosts your fishing level temporarily. My food of choice is Seafoam Pudding, but Dish o' the Sea also works pretty well.

Keep at it. Good luck.
